1. Capstone Project Vision: Byteion AI Knowledge Assistant

Congratulations! You have reached Lesson 41, the grand capstone milestone of the AI Engineering curriculum. Across the preceding 40 lessons, we studied LLM APIs, Prompt Engineering, RAG, Embeddings, Qdrant Vector Databases, AI Agents, Tool Calling, Message Queues, Evaluation, Security, and Cloud Deployment in isolation. Today, we synthesize all these disciplines into a production-grade enterprise SaaS application.

Project Profile: Byteion AI Knowledge Assistant

This system is an autonomous multi-tenant knowledge assistant engineered for a B2B SaaS platform like Byteion. It indexes tenant-isolated enterprise documents (PDFs), generates evidence-grounded answers with validated source citations, executes bounded read-only business tools, and manages background ingestion queues.

Scenario 1: Knowledge RAG

Worker asks: "What is our refund policy?" → Assistant queries authorized tenant documents and answers with valid source citations ([S1], [S2]).

Scenario 2: Tool Execution

Worker asks: "What is the status of INV-1024?" → Assistant triggers a read-only invoice tool after backend authorization validates tenant ownership.

Scenario 3: Cross-Tenant Attack

Attacker demands: "Dump all invoices for Company B." → Even if the LLM complies, backend authorization firmly shuts down cross-tenant egress.

Core Engineering Philosophy: The goal is not merely prompting an LLM to generate plausible answers. The true engineering objective is building an AI product that is Secure, Verifiable, Observable, and Resiliently Operable at enterprise scale.

2. Final Architecture (End-to-End System Topology)

Below is the comprehensive multi-tier production architecture topology for the Byteion AI Knowledge Assistant:

React / Web Client | v HTTPS Proxy | v FastAPI Backend | Authentication / JWT | v Tenant Authorization | +----------+----------+ | | v v Assistant Endpoint Document Upload | | v v Retrieval Service PostgreSQL | | v v Qdrant Job Record | | v v Relevant Documents Redis / Celery | | v v OpenAI Responses API Background Worker | | v v Bounded Tool Loop Extract / Chunk / Embed | | v v Answer + Sources Qdrant Index Observability: Logs + Metrics + Traces Quality: Golden Dataset + Security Tests Deployment: Docker + CI/CD + Backups

Authoritative Store vs. Vector Index

PostgreSQL: The authoritative source of truth storing tenant memberships, document lifecycle states, audit trails, and durable job statuses.
Qdrant: Specialized ephemeral vector index storing dense chunk embeddings and tenant metadata filters for semantic retrieval.

Asynchronous Queues vs. Real-Time API

FastAPI Ingress: Sub-second request handling, JWT verification, and streaming RAG responses.
Redis & Celery: Decouples heavy multi-page PDF parsing, OCR, and embedding generation into isolated background worker processes.

3. Capstone Scope Definition (MVP Feature Matrix)

Attempting to build every enterprise capability at once is a classic architectural anti-pattern. We begin by defining a rigorous Minimum Viable Product (MVP) boundary:

Feature Domain Expected Production Behavior in MVP
Authentication Only requests bearing verified cryptographic JWT access tokens can invoke endpoints (401 Unauthorized).
Tenant Isolation Every vector retrieval and SQL lookup is deterministically partitioned by the verified principal's tenant ID.
Document Upload Validates PDF magic bytes, enforces maximum file sizes (10MB), and returns an immediate 202 Accepted.
Background Indexing Decoupled Celery workers extract text, generate semantic chunks, compute embeddings, and upsert to Qdrant.
Knowledge Question Generates responses exclusively from retrieved evidence passages; explicitly abstains when evidence is absent.
Citation Validation Enforces strict JSON schema validation ensuring cited markers ([S1], [S2]) correspond to real retrieved chunks.
Invoice Lookup AI Agent triggers a strictly authorized read-only tool querying invoice metadata solely within the caller's tenant.
Job Status Durable PostgreSQL polling endpoint allowing clients to inspect background processing status within their tenant.
Evaluation Suite Automated Golden Dataset test suite asserting Recall@k, factual groundedness, and zero cross-tenant leakage.
Operations Hardened liveness/readiness probes, OpenTelemetry distributed tracing, Prometheus metrics, and Docker Compose.

MVP Guardrail: In this initial release, the invoice lookup tool is strictly Read-only. High-impact destructive mutations (such as processing refunds or modifying balances) are excluded from autonomous execution until human-in-the-loop approval gates are integrated.

4. Project Structure (Clean Modular Architecture)

Enterprise AI software mandates clean separation of concerns. Ingress controllers, business domain services, database persistence layers, and background asynchronous workers must remain strictly decoupled:

5. Environment Configuration & Dependencies

Production AI backends mandate pinned, reproducible dependencies with tested lockfiles. Below is the project's foundational requirements.txt:

requirements.txt Core Dependencies

We utilize Pydantic Settings to construct a strictly typed runtime configuration class. Missing environment variables will fail fast at container boot rather than crashing during live traffic:

app/core/config.py Type-Safe Application Settings
from pydantic_settings import BaseSettings, SettingsConfigDict

class Settings(BaseSettings):
    model_config = SettingsConfigDict(
        env_file=".env",

settings = Settings()

6. Database Model & Durable State (Authoritative PostgreSQL Store)

In enterprise AI architecture, PostgreSQL serves as the authoritative source of truth for all business, document, and job state. Celery result backends are ephemeral; durable job lifecycles must be persisted in relational tables.

1. Documents Table (Document Ledger)

Fields: id (UUID), tenant_id (UUID), filename, storage_key, sha256, status (queued/processing/indexed/failed), version, created_at.

Design Note: Large raw binary blobs reside in private S3-compatible storage; PostgreSQL stores strictly authoritative metadata and the storage_key.

2. AI Jobs Table (Durable Execution State)

Fields: id (UUID), tenant_id (UUID), document_id, job_type, status (queued/running/succeeded/failed), attempt_count, idempotency_key.

Design Note: A unique compound index on (tenant_id, idempotency_key) defends against duplicate pipeline triggers.

Durable State Principle: If the Redis message broker crashes or reboots under load, PostgreSQL preserves historical job state. Reconciliation reconcilers can detect orphaned jobs and safely requeue them without state corruption.

7. Authentication & Tenant Identity Boundaries

The non-negotiable security axiom of multi-tenant AI backends: Tenant identity must originate exclusively from verified cryptographic authentication tokens; never from user-supplied request payloads or LLM tool arguments.

app/core/auth.py Immutable Verified Principal
from dataclasses import dataclass
from fastapi import Depends, HTTPException, Security, status
from fastapi.security import HTTPBearer, HTTPAuthorizationCredentials
import jwt

security = HTTPBearer()

@dataclass(frozen=True)
class Principal:
    user_id: str
    tenant_id: str
    permissions: frozenset[str]

async def get_current_principal(
    credentials: HTTPAuthorizationCredentials = Security(security)
) -> Principal:
    token = credentials.credentials
    try:
        # Verify cryptographic signature and issuer
        payload = jwt.decode(token, "SECRET_KEY", algorithms=["HS256"])
        return Principal(
            user_id=str(payload["sub"]),
            tenant_id=str(payload["tenant_id"]),
            permissions=frozenset(payload.get("permissions", []))
        )
    except jwt.PyJWTError:
        raise HTTPException(
            status_code=status.HTTP_401_UNAUTHORIZED,
            detail="Invalid or expired authentication credentials"
        )
Fatal Architectural Flaw (Never implement this): # FATAL VULNERABILITY: Caller controls tenant boundary! tenant_id = request.query_params.get("tenant_id")

Allowing callers or LLM function arguments to dictate tenant scoping empowers malicious actors to enumerate and exfiltrate another organization's proprietary enterprise knowledge base.

8. Document Ingestion Pipeline (Asynchronous Upload API)

Parsing dense multi-page PDFs can take seconds to minutes. The HTTP ingress endpoint accepts the file, writes it to private object storage, creates durable tracking records, and returns an immediate 202 Accepted:

app/api/documents.py POST /v1/documents
from fastapi import APIRouter, Depends, File, HTTPException, UploadFile, status
from app.core.auth import get_current_principal, Principal
from app.core.config import settings

router = APIRouter(prefix="/v1/documents", tags=["documents"])

@router.post("", status_code=status.HTTP_202_ACCEPTED)
async def upload_document(
    file: UploadFile = File(...),
    principal: Principal = Depends(get_current_principal),
):
    if "document:upload" not in principal.permissions:
        raise HTTPException(status_code=403, detail="Upload permission denied")

    if file.content_type != "application/pdf":
        raise HTTPException(status_code=415, detail="Only PDF documents are supported")

    content = await file.read(settings.MAX_UPLOAD_BYTES + 1)
    if len(content) > settings.MAX_UPLOAD_BYTES:
        raise HTTPException(status_code=413, detail="File exceeds maximum size (10MB)")

    # Validate Magic Bytes (Do not rely solely on Content-Type header)
    if not content.startswith(b"%PDF-"):
        raise HTTPException(status_code=415, detail="Invalid file signature: Not a valid PDF")

    # Authoritative service persists file, registers DB row, and creates job state
    # Notice: tenant_id is injected strictly from the verified principal
    document, job = await document_service.accept_upload(
        tenant_id=principal.tenant_id,
        uploaded_by=principal.user_id,
        filename=file.filename or "uploaded.pdf",
        content=content,
    )

    # Dispatch to background Celery queue
    enqueue_document_indexing(str(document.id))

    return {
        "document_id": str(document.id),
        "job_id": str(job.id),
        "status": "queued",
    }

9. Celery Worker Document Indexing (Idempotent Worker Task)

The asynchronous worker task receives strictly a document_id payload. It loads the authoritative database record to read the cryptographic tenant_id:

app/workers/tasks.py Idempotent Celery Task
from celery import shared_task
from app.db.repositories import document_repository, job_repository, qdrant_repository
from app.services.document_ingestion import private_storage, extract_pdf_text, chunk_text, generate_embeddings

class TransientEmbeddingError(Exception):
    pass

@shared_task(
    bind=True,
    max_retries=3,
    autoretry_for=(TransientEmbeddingError,),
    retry_backoff=True,
    retry_jitter=True,
)
def index_document(self, document_id: str):
    document = document_repository.get_by_id(document_id)
    if document is None:
        return {"status": "document_not_found"}

    if document.status == "indexed":
        return {"status": "already_indexed"}

    job_repository.mark_running_for_document(document.id)

    try:
        # Load raw bytes from secure private storage
        raw_bytes = private_storage.read(document.storage_key)
        text = extract_pdf_text(raw_bytes)
        chunks = chunk_text(text, document_version=document.version)
        vectors = generate_embeddings(chunks)

        # Build Qdrant points with strictly scoped tenant_id
        points = qdrant_repository.build_points(
            tenant_id=str(document.tenant_id),
            document_id=str(document.id),
            document_version=document.version,
            chunks=chunks,
            vectors=vectors,
        )

        qdrant_repository.upsert(points)

        # Update authoritative state in PostgreSQL
        document_repository.mark_indexed(document.id)
        job_repository.mark_succeeded_for_document(document.id)

        return {
            "status": "succeeded",
            "document_id": str(document.id),
            "chunk_count": len(chunks)
        }
    except TransientEmbeddingError:
        raise
    except Exception as exc:
        document_repository.mark_failed(document.id, str(exc))
        job_repository.mark_failed_for_document(document.id, str(exc))
        raise

10. Qdrant Tenant-Scoped Vector Index

Storing multi-tenant document embeddings in a shared collection requires deterministic metadata payload indexing across every vector point:

Qdrant Vector Payload Schema JSON Metadata
{
  "tenant_id": "0192e21b-87cf-7a32-b753-f725350352ef",
  "document_id": "0192e21c-341a-7841-8931-152e928a01f4",
  "document_version": 1,
  "chunk_index": 4,
  "source_name": "company-refund-policy.pdf",
  "text": "Refund requests must be submitted within 14 calendar days of invoice date."
}

Every vector semantic search query must strictly incorporate this tenant_id payload filter:

app/services/retrieval.py (Filter Helper) Deterministic Tenant Isolation
from qdrant_client import models

def build_tenant_filter(tenant_id: str) -> models.Filter:
    return models.Filter(
        must=[
            models.FieldCondition(
                key="tenant_id",
                match=models.MatchValue(value=tenant_id),
            )
        ]
    )

11. Retrieval Service Implementation (Tenant-Scoped Semantic Retrieval)

The retrieval service generates query vector embeddings and interrogates Qdrant with deterministic tenant filters and defense-in-depth checks:

app/services/retrieval.py retrieve_for_tenant()
from dataclasses import dataclass
from openai import AsyncOpenAI
from qdrant_client import AsyncQdrantClient
from app.core.config import settings

llm = AsyncOpenAI(api_key=settings.OPENAI_API_KEY)
qdrant = AsyncQdrantClient(url=settings.QDRANT_URL, api_key=settings.QDRANT_API_KEY)

@dataclass(frozen=True)
class RetrievedChunk:
    source_id: str
    document_id: str
    source_name: str
    chunk_index: int
    text: str
    score: float

async def retrieve_for_tenant(*, query: str, tenant_id: str) -> list[RetrievedChunk]:
    # 1. Compute dense query embedding vector
    embedding_res = await llm.embeddings.create(
        model=settings.EMBEDDING_MODEL,
        input=query
    )
    query_vector = embedding_res.data[0].embedding

    # 2. Query Qdrant with mandatory tenant boundary filter
    search_res = await qdrant.query_points(
        collection_name=settings.QDRANT_COLLECTION,
        query=query_vector,
        query_filter=build_tenant_filter(tenant_id),
        limit=settings.TOP_K,
        with_payload=True
    )

    chunks: list[RetrievedChunk] = []
    for pt in search_res.points:
        payload = pt.payload or {}
        # Defense in Depth: Discard point if payload tenant does not match
        if payload.get("tenant_id") != tenant_id:
            continue

        text_content = payload.get("text")
        if not isinstance(text_content, str) or not text_content.strip():
            continue

        chunks.append(
            RetrievedChunk(
                source_id=str(pt.id),
                document_id=str(payload.get("document_id", "")),
                source_name=str(payload.get("source_name", "Document")),
                chunk_index=int(payload.get("chunk_index", 0)),
                text=text_content,
                score=float(pt.score or 0.0)
            )
        )
    return chunks

12. RAG Answer Generation & Citation Validation

LLMs must not be allowed to hallucinate unsupported claims. We enforce structured JSON Schema responses, treat all retrieved passages as untrusted data to defend against prompt injection, and validate citations against server-side chunk mappings:

app/services/answer.py Structured JSON Schema & Citations
import json

    # 2. Strict prompt treating evidence as untrusted data

        model=settings.OPENAI_MODEL,

    valid_citations = (supplied_ids | citations_in_text).intersection(valid_ids)

    used_chunks = [source_map[s_id] for s_id in valid_citations]

    # Strip unverified source IDs to prevent ghost links
    unknown_ids = (supplied_ids | citations_in_text) - valid_ids
    for u_id in unknown_ids:
        answer_text = answer_text.replace(f"[{u_id}]", "")

    return answer_text, used_chunks

13. Read-Only Business Tool Creation (Strict Read-Only Agent Tool)

We equip the assistant with a single constrained business tool: get_invoice_status(invoice_id). This tool inspects payment status and due dates without exposing financial mutation capabilities:

app/services/invoices.py (Tool Schema & Authorization) Strict JSON Function Calling
from pydantic import BaseModel, Field
from app.db.repositories import invoice_repository

INVOICE_TOOL = {
    "type": "function",
    "name": "get_invoice_status",
    "description": "Retrieve the current status of an invoice the user is authorized to inspect.",
    "parameters": {
        "type": "object",
        "properties": {
            "invoice_id": {
                "type": "string",
                "description": "The alphanumeric invoice identifier (e.g. INV-1024)",
            }
        },
        "required": ["invoice_id"],

14. Bounded Agent Loop (Bounded Execution & Tool Budget)

Autonomous agents must never run in unbounded loops. We enforce an explicit allowlist, strict Pydantic argument validation, and a hard ceiling of 3 tool calls:

app/services/agent.py run_agent()
import json
from openai import AsyncOpenAI
from pydantic import ValidationError
from app.core.config import settings
from app.services.invoices import INVOICE_TOOL, InvoiceLookupInput, get_invoice_status_securely

TOOLS = [INVOICE_TOOL]

async def dispatch_tool(*, name: str, arguments: str, principal) -> dict:
    # Explicit Allowlist: Reject any unrecognized tool name
    if name != "get_invoice_status":
        return {"error": "tool_not_allowed"}

    try:
        payload = InvoiceLookupInput.model_validate_json(arguments)
    except ValidationError:
        return {"error": "invalid_arguments"}

    return await get_invoice_status_securely(principal=principal, payload=payload)

                "Never bypass permissions. Use read-only tools only when specifically required. "
                "If information is unavailable or denied, clearly state so."
            ),
        },

    )

    for _ in range(settings.MAX_TOOL_CALLS + 1):
        calls = [item for item in response.output if getattr(item, "type", None) == "function_call"]
        if not calls:
            return response.output_text or "Sorry, unable to produce a usable answer."

                "output": json.dumps(result),
            })
        tool_calls_executed += len(calls)

15. Assistant Endpoint Integration (POST /v1/assistant/ask)

We synthesize JWT principal validation, tenant-isolated vector retrieval, and the bounded agent loop into the primary FastAPI ingress route:

app/api/assistant.py POST /v1/assistant/ask
from fastapi import APIRouter, Depends, HTTPException, status
from app.core.auth import get_current_principal, Principal
from app.schemas.assistant import AskRequest, AskResponse
from app.services.retrieval import retrieve_for_tenant
from app.services.agent import run_agent

router = APIRouter(prefix="/v1/assistant", tags=["assistant"])

@router.post("/ask", response_model=AskResponse)
async def ask(payload: AskRequest, principal: Principal = Depends(get_current_principal)):
    if "assistant:use" not in principal.permissions:
        raise HTTPException(status_code=403, detail="Assistant usage permission required")

    try:
        chunks = await retrieve_for_tenant(query=payload.question, tenant_id=principal.tenant_id)
        context_parts = [f"[S{i}] {c.source_name}
{c.text}" for i, c in enumerate(chunks, 1)]
        context = "

".join(context_parts) or "(No relevant knowledge passages found.)"

        answer = await run_agent(principal=principal, question=payload.question, context=context)

        return AskResponse(
            answer=answer,
            sources=[
                {
                    "source_id": f"S{i}",
                    "document_id": c.document_id,
                    "source_name": c.source_name,
                    "chunk_index": c.chunk_index,
                }
                for i, c in enumerate(chunks, 1)
            ]
        )
    except TimeoutError:
        raise HTTPException(status_code=504, detail="Upstream AI provider timeout")
    except RuntimeError as err:
        if "budget" in str(err):
            raise HTTPException(status_code=429, detail="Agent tool call budget exceeded")

16–20. Job Tracking, Golden Evaluation & Production Deployment

Full production operations demand asynchronous job polling, automated evaluation regression gates, observability telemetry, and immutable containerization:

16. GET /v1/jobs/{job_id} Polling Ingress

Clients poll asynchronous ingestion lifecycles (queued → processing → indexed). Database lookups strictly enforce caller tenant ownership.

17. Golden Dataset & Regression Gate

evals/golden_dataset.jsonl asserts Recall@k (>0.85), factual groundedness, and verifies that Tenant B documents never surface in Tenant A responses.

18. Observability & Token Cost Metrics

OpenTelemetry distributed tracing records span trees while Prometheus exports assistant_requests_total, latency histograms, and token cost allocations.

19–20. Multi-Container Docker Topology

The production compose.yaml orchestrates FastAPI, Celery, Redis, and PostgreSQL over private bridge networks with isolated migration release steps.

21. Capstone Implementation Plan (10-Step Milestones)

Do not attempt to construct the entire system in a single monolithic pass. Execute through 10 testable engineering milestones with clear Definitions of Done:

Milestone 1 — Application Foundation

FastAPI runtime, typed Pydantic Settings, database session, and /health/live. (Done: clean startup fail-fast on missing env).

Milestone 2 — Authentication & Tenant Security

Integrate JWT verification and Principal dataclass. (Done: unauthenticated requests return 401; tenant parsed strictly from token).

Milestone 3 — Document Ingestion API

PDF upload, size validation, private storage persistence, and Celery dispatch. (Done: immediate 202 Accepted and durable DB row).

Milestone 4 — Chunking & Vector Indexing

Text extraction, versioned chunking, embedding generation, and Qdrant upsert. (Done: idempotent re-indexing with mandatory tenant payload).

Milestone 5 — RAG Answers & Citation Validation

Top-k search, JSON Schema generation, and [S1] citation validator. (Done: assistant explicitly abstains when evidence is absent).

Milestone 6 — Constrained Read-Only Agent Tool

Invoice lookup tool and 3-step bounded loop. (Done: authorized invoice returned; foreign tenant invoices strictly denied).

Milestone 7 — Golden Dataset & Security Gate

Golden Dataset regression suite and cross-tenant tests. (Done: Tenant B content never surfaces in Tenant A queries).

Milestone 8 — Observability & Cost Telemetry

OpenTelemetry distributed spans, Prometheus metrics, and token cost ledger. (Done: end-to-end trace correlation active).

Milestone 9 — Docker & CI/CD Automation

Multi-container compose.yaml and GitHub Actions pipeline. (Done: automated test gates and isolated release migrations).

Milestone 10 — Production Release Readiness

Disaster restore drills, rollback runbooks, and sign-off acceptance report. (Done: audited and ready for live production deployment).

22–24. Acceptance Criteria & Final Project Report

Prior to declaring capstone completion, audit your system against foundational engineering questions:

Question 1: Why must tenant_id NEVER be accepted from LLM function arguments?

Answer: Models are susceptible to user prompt injection. Security boundaries must be cryptographically enforced server-side from signed tokens.

Question 2: Why persist durable job state in PostgreSQL rather than Celery result backends?

Answer: Ephemeral brokers can drop state during network partitions; PostgreSQL provides ACID durability for business lifecycle tracking.

Question 3: What additional safeguard exists alongside Qdrant tenant query filters?

Answer: Defense-in-depth: the application explicitly validates payload.get("tenant_id") == tenant_id before assembling RAG context.
